Cette dimension a longtemps \u00e9t\u00e9 n\u00e9glig\u00e9e, cr\u00e9ant nombres de scandales d\u2019IA racistes ou sexistes. L\u2019\u00e9quit\u00e9 cherche \u00e0 recentrer la notion le respect de l\u2019\u00eatre humain, afin de ma\u00eetriser les risques de discrimination.<\/p>\n\n\n\n<h2 class=\"wp-block-heading\" id=\"h-l-equite-qu-est-ce-que-c-est-nbsp\">L\u2019\u00e9quit\u00e9, qu\u2019est-ce que c\u2019est&nbsp;?<\/h2>\n\n\n\n<p>L\u2019\u00e9quit\u00e9, c\u2019est \u00ab&nbsp;attribuer \u00e0 chacun ce qui lui est d\u00fb par r\u00e9f\u00e9rence aux principes de la justice naturelle et de l\u2019impartialit\u00e9&nbsp;\u00bb, nous apprend le dictionnaire Larousse. Appliqu\u00e9e \u00e0 l\u2019IA, cette d\u00e9finition va prendre quatre significations op\u00e9rationnelles&nbsp;:<\/p>\n\n\n\n<h4 class=\"wp-block-heading\" id=\"h-definir-les-groupes-sensibles\"><strong>D\u00e9finir les groupes sensibles<\/strong><\/h4>\n\n\n\n<p>Si l\u2019un des objectifs de l\u2019\u00e9quit\u00e9 consiste \u00e0 \u00e9viter la discrimination, encore faut-il savoir quels groupes sont susceptibles d\u2019\u00eatre discrimin\u00e9s. Ces groupes sont en g\u00e9n\u00e9ral tr\u00e8s d\u00e9pendants du cas d\u2019usage&nbsp;: personnes ma\u00eetrisant mal le langage (enfants, handicap\u00e9s, \u00e9trangers)&nbsp;; apparence physique (\u00e2ge, genre, ethnie)&nbsp;; revenus&nbsp;; localisation g\u00e9ographique&nbsp;; pour ne citer que les plus courants.<\/p>\n\n\n\n<p>Une bonne pratique est de consid\u00e9rer qu\u2019un groupe est sensible d\u00e8s lors que les personnes n\u2019ont pas choisi d\u2019appartenir \u00e0 ce groupe, soit par des facteurs inn\u00e9s (couleur de peau, langue maternelle), soit par des facteurs soci\u00e9taux (pauvret\u00e9, g\u00e9ographie).<\/p>\n\n\n\n<h4 class=\"wp-block-heading\" id=\"h-controler-les-biais-de-donnees\"><strong>Contr\u00f4ler les biais de donn\u00e9es<\/strong><\/h4>\n\n\n\n<p>On ne ma\u00eetrise une source de donn\u00e9es que quand on conna\u00eet bien tous les biais qui la constituent. Contr\u00f4ler les biais dans les donn\u00e9es, c\u2019est donc un travail de recensement et de quantification de tous les diff\u00e9rents biais possibles.<\/p>\n\n\n\n<p>D\u2019une mani\u00e8re g\u00e9n\u00e9rale, les personnes qui \u00e9mettent peu de donn\u00e9es ou des donn\u00e9es de mauvaise qualit\u00e9 sont souvent mal repr\u00e9sent\u00e9es&nbsp;num\u00e9riquement : l\u2019illectronisme touche plusieurs millions de personnes en France, et les minorit\u00e9s sont souvent \u00e9galement minoritaires dans les donn\u00e9es. A cela s\u2019ajoute le contexte socio-\u00e9conomique, qui peut v\u00e9hiculer des biais de soci\u00e9t\u00e9 pass\u00e9s ind\u00e9sirables aujourd\u2019hui (clich\u00e9s, racisme, misogynie, etc.).<\/p>\n\n\n\n<h4 class=\"wp-block-heading\" id=\"h-controler-les-biais-de-modelisation\"><strong>Contr\u00f4ler les biais de mod\u00e9lisation<\/strong><\/h4>\n\n\n\n<p>Trop souvent, la performance d\u2019un mod\u00e8le est r\u00e9duite \u00e0 une simple moyenne prise sur toute la population. C\u2019est une erreur m\u00e9thodologique grave, et dangereuse. Un diagnostic m\u00e9dical peut ne cr\u00e9er que 1% d\u2019erreurs, si toutes ces erreurs sont concentr\u00e9es sur un groupe sensible particulier sans aucune justification biologique, c\u2019est une marque de discrimination flagrante.<\/p>\n\n\n\n<p>Ma\u00eetriser les biais de mod\u00e9lisation, c\u2019est donc avant tout \u00eatre capable de segmenter ses analyses de performance, et d\u2019assurer non seulement le plus haut niveau de performance global, mais aussi au sein de chaque groupe sensible. On attend d\u2019un mod\u00e8le \u00e9quitable que sa performance et son niveau d\u2019incertitudes soient sensiblement identiques d\u2019un groupe sensible \u00e0 l\u2019autre.<\/p>\n\n\n\n<h4 class=\"wp-block-heading\" id=\"h-controler-les-biais-d-interaction\"><strong>Contr\u00f4ler les biais d\u2019interaction<\/strong><\/h4>\n\n\n\n<p>L\u2019interaction homme-machine est \u00e9galement biais\u00e9e&nbsp;: les d\u00e9cideurs ont tendance \u00e0 suivre les recommandations de l\u2019IA (biais de confirmation). A cela s\u2019ajoute d\u2019autres biais cognitifs : l\u2019effet \u00ab&nbsp;mouton de Panurge&nbsp;\u00bb, qui consiste \u00e0 suivre les d\u00e9cisions du plus grand nombre, ou encore le biais de s\u00e9lection des interactions humaines, comme les commentaires de satisfaction, qui sont plus souvent r\u00e9dig\u00e9s par des personnes insatisfaites.<\/p>\n\n\n\n<p>Dans un cas d\u2019usage IA, l\u2019\u00e9quit\u00e9 n\u2019est pas circonscrite \u00e0 l\u2019algorithme&nbsp;: bien au contraire, elle englobe toute la cha\u00eene de d\u00e9cision, y compris les d\u00e9cideurs finaux. Un algorithme peut tr\u00e8s bien faire une recommandation non-discriminante, mais son utilisateur peut continuer \u00e0 discriminer. C\u2019est ce qui a \u00e9t\u00e9 observ\u00e9 dans certaines applications de covoiturage, o\u00f9 cacher le nom\/pr\u00e9nom des conducteurs et des passagers changeait le taux d\u2019acceptation de certaines populations par les uns et les autres.<\/p>\n\n\n\n<h2 class=\"wp-block-heading\" id=\"h-l-equite-comment-l-activer-nbsp\"><strong>L\u2019\u00e9quit\u00e9, comment l\u2019activer&nbsp;?<\/strong><\/h2>\n\n\n\n<p>Impl\u00e9menter des IAs \u00e9quitables est plus facile \u00e0 dire qu\u2019\u00e0 faire&nbsp;! Heureusement, trois actions de bon sens permettent de faire l\u2019essentiel du chemin.<\/p>\n\n\n\n<h4 class=\"wp-block-heading\" id=\"h-specifier\">Sp\u00e9cifier<\/h4>\n\n\n\n<p>La premi\u00e8re action \u00e0 mettre en place est politique&nbsp;: d\u00e9finir les groupes sensibles susceptibles d\u2019\u00eatre discrimin\u00e9s. C\u2019est bien une action politique car elle fait appel \u00e0 des notions \u00e9thiques. Cette action demande \u00e9galement un effort d\u2019anticipation : \u00ab&nbsp;qu\u2019est-ce qui pourrait mal se passer avec ce cas d\u2019usage, et quelles populations seraient impact\u00e9es&nbsp;?&nbsp;\u00bb. Les chartes \u00e9thiques des entreprises peuvent servir de boussoles pour orienter les r\u00e9flexions.<\/p>\n\n\n\n<p>En compl\u00e9ment, sp\u00e9cifier des m\u00e9triques d\u2019\u00e9quit\u00e9 quantifiables, mesurables, ainsi que des objectifs \u00e0 atteindre permet de factualiser et d\u2019auditer la d\u00e9marche mise en \u0153uvre.<\/p>\n\n\n\n<h4 class=\"wp-block-heading\" id=\"h-detecter\">D\u00e9tecter<\/h4>\n\n\n\n<p>La deuxi\u00e8me action r\u00e9side dans l\u2019analyse des biais. Le contexte socio-\u00e9conomique n\u2019est pas neutre, et induit en g\u00e9n\u00e9ral une repr\u00e9sentation biais\u00e9e de certaines populations dans le monde digital. Certaines donn\u00e9es \u00e0 premi\u00e8re vue anodines sont en r\u00e9alit\u00e9 des proxys de variables sensibles. Par exemple, le m\u00e9tier peut \u00eatre un proxy du genre, le salaire un proxy de l\u2019\u00e2ge, le lieu d\u2019habitation un proxy de l\u2019origine ethnique, etc. R\u00e9pertorier les variables sensibles (pr\u00e9sentes ou non dans le jeu de donn\u00e9es), et leurs proxys est un premier travail pr\u00e9paratoire \u00e0 l\u2019identification des biais.<\/p>\n\n\n\n<p>Une fois ce premier travail effectu\u00e9, on peut alors tenter de r\u00e9pondre \u00e0 ces questions&nbsp;: est-ce que le jeu de donn\u00e9es est repr\u00e9sentatif de la population cible&nbsp;? est-ce que la qualit\u00e9 de donn\u00e9es est bien homog\u00e8ne dans les groupes sensibles&nbsp;? est-ce que les performances et les incertitudes sont bien homog\u00e8nes dans les groupes sensibles&nbsp;?<\/p>\n\n\n\n<h4 class=\"wp-block-heading\" id=\"h-corriger\">Corriger<\/h4>\n\n\n\n<p>Une fois identifi\u00e9s les biais pr\u00e9sents dans les donn\u00e9es d\u2019entr\u00e9e ou les pr\u00e9dictions du mod\u00e8le, il devient souvent beaucoup plus facile d\u2019y rem\u00e9dier. Toutes les solutions ne sont pas techniques, loin s\u2019en faut&nbsp;: souvent, c\u2019est par la gouvernance de la donn\u00e9e, ou l\u2019acquisition de nouvelles donn\u00e9es, que les probl\u00e8mes sont r\u00e9solus. Si cela ne suffit pas, on peut alors, envisager de \u00ab&nbsp;r\u00e9parer&nbsp;\u00bb le biais identifi\u00e9, \u00e0 conditions de ma\u00eetriser les effets de bords (<a href=\"https:\/\/towardsdatascience.com\/tutorial-breaking-myths-about-ai-fairness-the-case-of-biased-automated-recruitment-9ee9b2ecc3a\">voir notre article illustratif \u00e0 sujet<\/a>).<\/p>\n\n\n\n<p>Par exemple, on peut r\u00e9parer la donn\u00e9e par un pr\u00e9-traitement, en r\u00e9\u00e9chantillonnant le jeu de donn\u00e9es pour le rendre plus repr\u00e9sentatif ou accentuer les \u00e9v\u00e9nements rares. On peut appliquer des post-traitements, en ajustant des seuils de d\u00e9tection, ou en hybridant le mod\u00e8le avec des garde-fous&nbsp;comme des r\u00e8gles m\u00e9tiers. Enfin, on peut aussi s\u00e9lectionner le mod\u00e8le en int\u00e9grant la m\u00e9trique d\u2019\u00e9quit\u00e9 dans la notion de performance op\u00e9rationnelle. Tout cela n\u2019a d\u2019int\u00e9r\u00eat et d\u2019impact que si la cha\u00eene de d\u00e9cision aval est elle-m\u00eame \u00e9quitable.<\/p>\n\n\n\n<h2 class=\"wp-block-heading\" id=\"h-l-equite-en-vrai-ca-donne-quoi-nbsp\">L\u2019\u00e9quit\u00e9, en vrai \u00e7a donne quoi&nbsp;?<\/h2>\n\n\n\n<p>Afin d\u2019illustrer ces concepts, voici comment nous avons rendu plus \u00e9quitable un mod\u00e8le de recommandations chez l\u2019un de nos clients, leader du secteur des t\u00e9l\u00e9communications.<\/p>\n\n\n\n<p>A des fins marketing, on cherche \u00e0 estimer un score d\u2019app\u00e9tence pour un produit, comme un abonnement TV. Un des pr\u00e9requis impos\u00e9s \u00e0 l\u2019IA par le m\u00e9tier est le suivant&nbsp;: les scores d\u2019app\u00e9tence doivent \u00eatre calibr\u00e9s, et repr\u00e9senter des probabilit\u00e9s d\u2019achat&nbsp;: si l\u2019algorithme donne un score de 0.2, il doit y avoir 20% de chances que le client soit app\u00e9tant.<\/p>\n\n\n\n<p>Ici, si l\u2019on consid\u00e8re le genre comme une variable sensible, on a pu mesurer que ces scores d\u2019app\u00e9tence \u00e9taient bien calibr\u00e9s au global, mais mal calibr\u00e9s pour les hommes ET pour les femmes&nbsp;: un score de 0.2 traduit bien une probabilit\u00e9 d\u2019achat de 20% au global, mais de 30% chez les hommes et 10% chez les femmes. La m\u00e9trique de Spiegelhalter quantifie si les pr\u00e9dictions sont bien calibr\u00e9es. Un \u00e9cart \u00e0 0 indique une mauvaise calibration. M\u00eame si l&#8217;algorithme \u00e9tait bien calibr\u00e9 au global, il \u00e9tait mal calibr\u00e9 pour les hommes et pour les femmes. En recalibrant le mod\u00e8le par groupe, on a atteint l\u2019objectif de calibration de mani\u00e8re globale et au sein de chaque groupe. Les bo\u00eetes \u00e0 moustache traduisent la variance d\u2019\u00e9chantillonnage sur la mesure.<\/em><\/p>\n\n\n\n<p>Apr\u00e8s rem\u00e9diation en post-traitement, qui consiste \u00e0 op\u00e9rer une recalibration au sein de chaque groupe, l\u2019objectif est atteint&nbsp;: quand l\u2019algorithme donne un score de 0.2, il y a bien 20% de chances que le client soit app\u00e9tant, et ce quel que soit son genre&nbsp;!<\/p>\n\n\n\n<p>Finalement, l\u2019algorithme, en \u00e9tant mieux calibr\u00e9 au sein de chaque groupe, a gagn\u00e9 en pertinence au global.
